3 Ways to Integrate LLMs into Enterprise Processes

Large language models moved from demo to production in a year. Three practical patterns for integrating them into enterprise systems, with the risk mitigations that matter.

In 2024 large language models were in the "future" category; in 2026 they are a layer sitting on top of your CRM, ticketing system and data warehouse. Integration, however, is not easy: hallucination risk, data leakage, cost control and enterprise-identity alignment are all real challenges. Three practical integration approaches that have matured in enterprise AI projects.

1. RAG (Retrieval-Augmented Generation)

The most common and safest starting point. Relevant chunks are retrieved from the enterprise document base or data store by vector search, passed to the LLM as context, and the answer is generated. Hallucination is significantly reduced because the model is forced to ground on a source. Example applications: customer support bots, internal document search, policy Q&A.

Critical decisions: which vector DB (pgvector, Weaviate, Pinecone), the chunking strategy, the embedding model (Voyage, OpenAI) and the citation format.

2. Agent Orchestration

Instead of a single request/response, the LLM runs multi-step tasks using multiple tools. Example: "Find the top five customers who bought most in March, rank them by average margin, and draft a personalised email for each." The agent produces a SQL query, then calls an analytics API, then generates text.

This pattern is powerful but risky: wrong tool choice, infinite loops, unauthorised access to critical operations. Production agents must include human-approval checkpoints, rate limiting and sandboxed tools.

3. Hybrid (Classical ML + LLM)

The LLM is not the right hammer for every nail. For a classification problem, a classical ML model is both cheaper and faster. Modern enterprise applications combine the two: classical ML produces a customer sentiment score, then an LLM writes a summary narrative.

Risks and Mitigations

  • Data leakage: sending enterprise data to a public LLM API may breach regulation. Enterprise options (Claude, Azure OpenAI) offer retention-off settings; on-premise options include Llama or Qwen.
  • Hallucination: RAG plus mandatory citations plus a confidence score in the UI.
  • Cost: token-based pricing adds up quickly. Introduce a cache layer, model routing (simple queries go to smaller models, complex ones to Opus-class) and usage quotas.
  • Enterprise identity: per-user access logs and audit trails are non-negotiable in production.
